What is Signal Processing?
Signal processing is the science of analyzing, modifying, and synthesizing signals—representations of physical phenomena that carry information. Imagine a microphone picking up sound waves, a camera capturing light, or a medical sensor measuring electrical activity in the heart. All of these devices generate signals that contain valuable information about the physical world.
The fundamental goal of signal processing is to extract useful information from a signal, improve its quality, or transform it into a more useful form for storage, transmission, or interpretation. For example, a streaming music service might use signal processing to compress audio files to save bandwidth, while a hospital might use it to filter noise from a patient's heart rate monitor to detect abnormalities more reliably.
The diagram above shows a typical signal processing pipeline: a physical phenomenon is sensed by a transducer (like a microphone), converted to an electronic signal, processed, and then transmitted or displayed. Understanding signal processing means understanding what happens in that processing stage.
Continuous-Time and Discrete-Time Signals
One of the most fundamental distinctions in signal processing is between continuous-time and discrete-time signals.
Continuous-time signals vary smoothly over time, existing at every instant. A classic example is an analog audio waveform—the sound wave from a speaker is a continuous signal, defined at every point in time. Mathematically, we write continuous-time signals as $x(t)$ where $t$ is time and can take any real value.
Discrete-time signals are sampled at regular intervals, creating a sequence of values measured only at specific instants. A digital audio file stored on your computer is a discrete-time signal—it contains measurements of sound amplitude at regular time intervals (usually 44,100 times per second for CD-quality audio), but nothing in between. We write discrete-time signals as $x[n]$ where $n$ is an integer index representing which sample we're looking at.
Why does this matter? Modern signal processing almost exclusively uses discrete-time signals because computers operate on numbers, not continuous functions. To work with any signal on a computer—whether it's audio, an image, or sensor data—we must first convert it from continuous time to discrete time through a process called sampling.
Sampling: Converting Continuous to Discrete
Sampling is the process of converting a continuous-time signal into a discrete-time signal by measuring its value at evenly spaced time instants. If we sample a signal every $Ts$ seconds, then the sampling rate (or sampling frequency) is $fs = 1/Ts$, measured in hertz (Hz).
Here's where a critical principle comes in: the Nyquist-Shannon sampling theorem. This theorem states that to avoid losing information, a signal must be sampled at least twice its highest frequency component. Mathematically, if the signal contains no frequency components above $f{max}$, then we need:
$$fs \geq 2f{max}$$
The frequency $fs/2$ is called the Nyquist frequency—it's the maximum frequency that can be accurately represented in a sampled signal.
Why does this matter? If you sample too slowly and miss the rapid changes in a signal, something called aliasing occurs. Aliasing is when high-frequency components "fold back" and masquerade as low-frequency components, corrupting your signal. For example, if you've ever seen a car wheel appear to spin backwards in a video, that's aliasing—the sampling rate of the video (typically 24-60 frames per second) is too slow to capture the wheel's rotation accurately.
To prevent aliasing in practice, an anti-aliasing filter is applied before sampling. This filter removes all frequency components above the Nyquist frequency, ensuring that the signal is "safe" to sample.
Reconstruction: Converting Discrete Back to Continuous
After processing a discrete-time signal, we often need to convert it back to continuous time. Reconstruction is the process of converting a discrete-time signal back into a continuous-time signal using interpolation—essentially, filling in the values between samples.
The ideal reconstruction method is sinc interpolation, which uses a special function called the sinc function to perfectly reconstruct a signal that was originally band-limited (had no frequency components above the Nyquist frequency). In practice, after interpolation, a reconstruction filter (typically a low-pass filter) is applied to smooth out any artifacts from the interpolation process.
This complete pipeline—anti-aliasing filter → sampling → processing → reconstruction filter → interpolation—ensures that signals can be converted to digital form, processed safely, and converted back to analog form without losing critical information.
Domain Representations of Signals
A signal can be viewed in different mathematical domains, each revealing different insights.
Time Domain
The time-domain representation plots signal amplitude (strength or magnitude) versus time. This is the most intuitive representation—it's literally what you'd see if you displayed a signal on an oscilloscope.
The plot above shows a realistic time-domain signal: it appears to be audio or sensor data with rapid fluctuations over time. Looking at the time domain tells you when things happen and how strong they are, but it doesn't easily tell you the frequencies present in the signal.
Frequency Domain
The frequency-domain representation shows how the signal's energy is distributed across different frequencies. Instead of plotting amplitude versus time, we plot amplitude versus frequency.
The plot above shows the same signal, but now displayed in the frequency domain. Notice the peaks at certain frequencies—these indicate that the signal contains strong oscillations at those frequencies, while other frequencies have much lower amplitudes. The frequency domain is created by applying a mathematical transformation (like the Fourier transform) to the time-domain signal.
The frequency domain is extraordinarily useful because many signal processing operations are easier to understand and implement in the frequency domain than in the time domain. For example, filtering out noise becomes simply "removing frequency components where the noise lives."
Fundamental Signal Processing Operations
Filtering: Emphasizing and Suppressing Frequencies
Filtering is one of the most common signal processing operations. A filter emphasizes or suppresses certain frequency components of a signal while leaving others relatively unchanged.
There are several standard filter types:
Low-pass filters remove high-frequency components while preserving low-frequency content. These are useful for removing high-frequency noise. For example, a low-pass filter on audio might remove hiss while preserving the bass and midrange notes.
High-pass filters do the opposite: they remove low-frequency components while preserving high-frequency detail. High-pass filters are useful for removing slow drift or removing rumbling low-frequency noise while keeping the details you care about.
Band-pass filters allow a specific range (band) of frequencies to pass through while attenuating frequencies both below and above that range. For example, a radio tuner uses a band-pass filter to isolate one radio station's frequency while rejecting all others.
The key insight is that filtering is fundamentally about controlling which frequencies are present in the signal. In the frequency domain, this is conceptually simple: multiply the signal's frequency components by 0 or 1 (or values in between) to suppress or pass those frequencies.
Transformation: Changing Domains
A transformation represents a signal in a different mathematical domain to simplify analysis or processing. The most important transformation in signal processing is the Fourier transform, which decomposes a signal into its sinusoidal frequency components.
The Fourier transform takes a time-domain signal and produces its frequency-domain representation. The inverse operation (the inverse Fourier transform) goes from frequency domain back to time domain. These two operations are mathematically dual—they contain exactly the same information, just represented differently.
For discrete-time signals, we use the Discrete Fourier Transform (DFT). The DFT converts a finite sequence of numbers into a frequency-domain representation. However, computing the DFT directly requires $N^2$ mathematical operations for $N$ samples, which is slow for large signals.
The Fast Fourier Transform (FFT) is an algorithm that computes the same result in only $N \log N$ operations. This reduction—from quadratic to logarithmic scaling—is enormous. Computing a DFT of 1 million samples would normally require about $10^{12}$ operations, but the FFT does it in about 20 million operations. This efficiency is why the FFT is one of the most important algorithms in signal processing.
Other Important Transforms
Beyond the Fourier transform, several other transforms are important for different applications:
The Laplace transform is used for analyzing continuous-time systems with exponential behavior. It's particularly valuable in control theory and system analysis, as it converts differential equations into algebraic equations that are easier to solve.
The Z-transform is the discrete-time counterpart of the Laplace transform. It's the fundamental tool for analyzing discrete-time systems like digital filters. Many digital filter design methods work in the Z-transform domain.
The wavelet transform provides time-frequency localization—it reveals which frequencies are present in a signal and at what times they appear. Unlike the Fourier transform, which tells you "this signal contains 500 Hz, but doesn't tell you when," the wavelet transform tells you "there's a burst of 500 Hz activity right here at 2.3 seconds." This makes wavelets particularly useful for analyzing non-stationary signals—signals whose frequency content changes over time (like music or speech).
Applications of Signal Processing
Signal processing isn't just theoretical—it's embedded in technology you use daily.
Audio and speech processing uses signal processing for compression (like MP3 audio), noise reduction in video calls, speech recognition, and audio effects. Compression algorithms exploit the fact that human hearing is insensitive to certain frequencies, allowing them to remove that information and dramatically reduce file sizes.
Medical imaging like MRI reconstructs spatial maps of tissue properties by analyzing radio-frequency signals. The signal processing here is sophisticated: raw signals are collected, transformed using Fourier techniques, filtered to remove noise, and reconstructed into the images you see.
Radar and communication systems use signal processing for detecting objects, measuring their velocity, filtering interference, demodulating received data, and decoding transmitted information. Modern cellular networks, WiFi, and satellite communications all rely on sophisticated signal processing to extract useful information from noisy, distorted received signals.
Building Blocks: Simple Signals
Before we process complex signals, it's important to understand simple basis signals—fundamental building blocks that can be combined to represent more complex signals.
Sinusoids (sine and cosine waves) are the most fundamental signals in signal processing. Any periodic signal can be represented as a sum of sinusoids at different frequencies and amplitudes—this is the essence of Fourier analysis. A sinusoid with frequency $f$ can be written as:
$$x(t) = A \sin(2\pi f t + \phi)$$
where $A$ is amplitude and $\phi$ is the phase shift.
Impulses (also called delta functions) are signals that are zero everywhere except at one instant where they "spike." An impulse is mathematically convenient because the response of a system to an impulse completely characterizes how that system will respond to any input signal.
Step functions are signals that are zero until a certain time, then become constant. Step functions are useful for modeling signals that suddenly turn on.
The principle of superposition states that complex signals can be represented as sums of these simpler signals. This is powerful: if you understand how a system responds to sinusoids, impulses, and steps, you can predict how it responds to any signal that's a combination of these.
Key Practical Considerations
Spectral Leakage and Windowing
When you compute a Fourier transform on a real-world signal of finite length, an artifact called spectral leakage can occur. The signal appears to have energy spread across neighboring frequencies even if it's a pure sinusoid. This happens because of how the FFT algorithm treats the edges of your signal.
To reduce spectral leakage, windowing is used: before taking the Fourier transform, multiply the signal by a smooth function (called a window) that gradually goes from 0 to 1 and back to 0. Common windows include the Hann window and Hamming window. This smooths the edges of the signal and reduces leakage. The tradeoff is that windowing slightly reduces frequency resolution—you can't distinguish frequencies that are extremely close together—but in practice this is usually a worthwhile tradeoff.
